LLM Fairness Evaluation

fairpipe’s LLM fairness evals measure disparate treatment in generative model behavior across demographic groups — not general answer quality (faithfulness, hallucination, RAG groundedness). This is Option A from the feature spec: an extension of fairpipe’s existing fairness measurement framework to LLM outputs.

What it measures

Four evaluators, all returning MetricResult and all calling apply_min_group_size() (default 5 per group):

Naive matched pairing is not used for the three rate metrics. A hiring-template design still balances sample size across groups; the disparity is a difference of group means.

refusal_rate_disparity detects phrase-level refusal signals (i cannot, i can't, cannot provide, …). It does not distinguish a genuine refusal to engage from a scope disclaimer on an otherwise complete answer, so it can saturate in advisory domains (BL-011).

Toxicity scoring is a lexical proxy by default (no moderation API key). Pass scorer= to ToxicitySentimentEvaluator.run_async to plug in an external moderator.

BBQ stereotype probe

Default CI uses a schema-compatible local subset (fixtures/bbq/gender_identity_subset.json), n=6 per group. See NOTICE and ATTRIBUTION.md (CC BY 4.0, https://github.com/nyu-mll/BBQ). BBQ encodes U.S. English social stereotypes; do not treat scores as a worldwide audit.

For the default case study and CI tests, fairpipe ships committed live-recorded responses (Anthropic Claude Haiku) replayed from cache — zero API calls, genuine model outputs.

For a deterministic local bias simulator (no API key, synthetic responses):

When cache_dir is set, fairpipe runs in replay-only mode: cache misses raise an error instead of calling the provider. Use default_recorded_counterfactual_config() for the shipped fixture path.

Credentials (OPENAI_API_KEY, ANTHROPIC_API_KEY) are read from environment variables only — never from YAML.

Optional counterfactual.name_pools maps {dimension: {group_label: [value_per_template, ...]}} so a probe can hold an explicit descriptor constant and vary only a demographically-coded name. Each pool list must match the template count exactly. Omit it to keep the literal group-label swap used by the hiring fixtures. Rotate names across templates by default — a single-name-per-group design can report a clean group disparity that is actually an artifact of one name string (humanitarian case study: David vs Tariq on an identical asylum template). provider: local does not support name-pool configsbiased_hiring_responder keys off the words "woman" / "man" in the prompt, so name-only templates would report zero disparity. Use a recorded cache or a live provider.

Aggregated metrics appear in the Markdown report. Raw probe transcripts are written to a separate JSON artifact (not rendered in CI summaries by default).

min_group_size: LLM evals default to 5 prompts per group (DEFAULT_LLM_MIN_GROUP_SIZE), below the classifier’s 30 because each sample is a paid API call. Groups below threshold are excluded silently; the metric is nan when fewer than two eligible groups remain — same semantics as NativeAdapter. Use allow_small_samples=True (Python) or --allow-small-samples (CLI) only for illustrative smoke tests.

Toxicity cache is currently a copy of the expanded hiring-response cache (same provider/model/params/prompts). That is enough to prove replay; it is not a disparity measurement. BBQ responses are recorded separately on an all-ambiguous local subset. The refusal fixture is a live humanitarian recording (not a hiring copy). All 15 responses score 1.0 under lexical refusal_score — a ceiling, not a disparity measurement. refusal_rate_disparity detects phrase-level refusal signals and does not distinguish a genuine refusal from a scope disclaimer on an otherwise complete answer (BL-011). Do not cite the pooled 0.0 as evidence of equal treatment.

Case study

case_studies/llm_counterfactual_fairness.ipynb walks through the counterfactual probe only (no API key):

  • Part Adefault_recorded_counterfactual_config() (n=1/group) → nan, empty eligible n_per_group. The three cached completions still replay; the guard fires afterward.

  • Part Bexpanded_recorded_counterfactual_config() (n=9/group, 27 Haiku texts) → finite ≈ 0.196 divergence and a percentile bootstrap CI on 27 template-level pairwise values. That number is lexical feature distance (token overlap dominates), not a group-effect size. A within-group control puts the no-effect baseline at ~0.19, not 0; a CI excluding 0 does not indicate a group effect (BL-012). The notebook is a pipeline demonstration (recording, replay, guards, CIs, provenance). The same MetricResult (value, ci, n_per_group, caveat) is what assert_llm_fairness(), Markdown reports, and MLflow consume.

If a Jupyter kernel is labeled .venv but sys.executable is Homebrew Python 3.12.12, the notebook prepends the repo root to sys.path. Prefer kernel Python (fairpipe .venv). A missing or wrong cache_dir raises LiveLLMCallForbidden immediately (live HTTP is forbidden by default). Replay of a valid recorded cache should finish in about a second.

CI/CD, REST, and production monitoring (Phase 3)

  • CLI gate: fairpipe llm-eval --metric ... --threshold ... — exit 0 pass / 1 fail / 2 usage / 3 illustrative (evaluate_llm_eval_gate()). A caveated metric exits 3 even when the number would pass. Dry-run stays 0 and does not call a provider.

  • REST: POST /llm-eval — same three-state gate_status / passed (null when illustrative). Credentials env-only; default body is aggregated metrics (no transcripts).

  • Local Action harness: run_llm_fairness_check() with Action-shaped with: keys. Wiring llm-fairness-check into SvrusIO/fairpipe-action is BL-010.

  • Production logs: sample_production_llm_records() keeps 1/N already-produced rows (group + 0/1 score, no provider HTTP) and feeds the existing tracker / drift engine. See Production Monitoring.

Live HTTP is forbidden by default. Opt in with FAIRPIPE_LLM_ALLOW_LIVE=1 on the process that should call a provider (Environment Variables).

Still open

  • BL-012counterfactual_fairness_divergence has no no-effect baseline; 0.196 / 0.202 are lexical distance, not group effects.

  • BL-009 — refusal fixture closed (real humanitarian cache). Refusal disparity-signal, toxicity (hiring-copy), and BBQ (all-ambiguous) still open.

  • BL-011refusal_score cannot distinguish refusal-to-engage from a scope disclaimer; the humanitarian recording saturates 15/15 as a result.
